Does TailRL lose more GSM8K accuracy than GRPO under 4-step rollout lag?

TailRL was only tested with synchronous rollouts. Under the same 4-step rollout lag, we compare TailRL's and GRPO's GSM8K accuracy drops.

Refine
Reproducible on Spindle: yes — Fits client-side RL on the tinker SDK. The TailRL loss runs through forward_backward_custom, and lag comes from sampling a checkpoint saved k steps earlier. The TailRL update rule is still unknown because the paper could not be fetched.

TailRL vs GRPO lag sensitivity on GSM8K, lag 0 vs lag 4

Hypothesis. On Qwen3.5-2B LoRA RL, TailRL's GSM8K test accuracy drop from lag 0 to lag 4 exceeds GRPO's drop by at least 0.03 absolute.

Method. Four LoRA RL arms start from the same Qwen/Qwen3.5-2B base: {GRPO, TailRL} x {lag 0, lag 4}. All arms share the GSM8K train prompts, prompt order, exact-match reward, group size, LR, LoRA rank and step count. They also share the same token-level importance correction against the sampler's logprobs.

Qwen/Qwen3.5-2B RL 40 steps batch 128 rank 32 gsm8k eval GSM8K test (openai/gsm8k main, test split) · exact-match accuracy, greedy decoding, final-step checkpoint 2 GPU-h 120 min cap

Success criterion. Validated if the 95% simultaneous paired_hoeffding lower bound of (TailRL_lag0 - TailRL_lag4) - (GRPO_lag0 - GRPO_lag4) GSM8K test accuracy exceeds 0.03. Failed (TailRL not more lag-sensitive) if the upper bound falls below 0.03. Otherwise inconclusive. Given a single checkpoint per arm and 1319 items, a half-width of about 0.15 is expected, so this pilot may not settle and is not a training-seed claim.

Each step t: sampler = sampler_ring[max(0, t-LAG)], where the ring holds tc.save_weights_for_sampler at every step; sample with sampler logprobs; reward is exact-match on the GSM8K '####' answer. GRPO computes reward minus group mean. TAILRL computes the paper's advantage/weight (pinned). Then tc.forward_backward_custom(batch, loss = -sum(min(exp(lp - sampler_lp), 2.0) * adv * lp_weight)) and tc.optim_step(tinker.AdamParams(learning_rate=4e-5)), for 40 steps. Eval: greedy sampling at the step-40 checkpoint on all 1319 GSM8K test items, exact-match, with per-item correctness saved for the paired test. Activation-failure plan: (1) offline, on a fixed saved batch, force TailRL weighting on and off and check gradient differences and that the off path equals GRPO; check that lag-4 sampler step indices are correct. (2) If the KL ratio is under 3.0, a recorded spec revision may raise lag to 8 (the only allowed calibration, at most 8 pilot steps, at most 10 wall-minutes) before the outcome runs. Calibration uses training-batch statistics only, never GSM8K test. The failed pilot logs are preserved and gates are never relaxed.",

GRPO uses group-mean-centered advantages. TailRL's advantage or loss must come from the paper (arXiv 2609.02987, not yet fetched), implemented client-side through forward_backward_custom. Its paper-default hyperparameters must be pinned before any arm runs. No Spindle fork is needed. The method's lag sensitivity is the decision under test. is TailRL more susceptible to rollout lag than traditional GRPO? the original experiments were purely sync, which was a detractor for the work. TailRL theory / explanation was quite compelling but if it can't be used async this would be a major downside for using it in prod runs. <https://zanette-labs.github.io/TailRL-website/|zanette-labs.github.io/TailRL-website> <https://arxiv.org/abs/2609.02987|arxiv.org/abs/2609.02987>

Not stated in the text available. Only the title, author list and affiliations were retrieved from the project page (CMU, UC Berkeley, Impossible Inc., Together AI, Aurora Innovation; 'Preprint, 2026'). The title suggests an RL method that targets the tail of the likelihood distribution, but this is an inference from the name alone. The linked idea text says TailRL has a 'compelling' theory/explanation and that its original experiments were purely synchronous. Neither statement can be checked against the retrieved text.
brief

method: Not stated. The retrieved page text contains no abstract, algorithm, loss, or hyperparameters, only a title block and a placeholder for a video ('Your browser cannot play this video'). The page text gives no description of how TailRL differs from GRPO, such as the objective, the weighting, or how 'tail' is defined. A triage agent should not assume any algorithmic detail. Before designing anything, fetch the arXiv abstract and paper (the idea links arxiv.org/abs/2609.02987; that ID looks unusual and should be verified) to get the actual update rule.

evidence: None available. The source text has no results, models, datasets, baselines or numbers. The retrieved text is effectively truncated to the title page. Claims in the idea text (sync-only experiments, strong theory) are the idea author's characterization and are unverified here.

reproduction: The method cannot be specified from this source, so only the experimental frame for the idea's question is given. - Data and eval: choose a verifiable-reward task (e.g., math with exact-match reward) on a small open model such as a Qwen3.5 small variant with LoRA. Use the paper's own tasks if they can be recovered from the full text. - Implementation: TailRL's loss must be taken from the paper. GRPO is the baseline, with the same data, reward, LoRA rank, learning rate, group size and step budget. - Core manipulation: rollout lag k, meaning rollouts are sampled from a policy k optimizer steps stale. Sweep k in {0, 1, 2, 4, 8} (suggested values, not from the source), with k=0 being the sync control. Report reward/pass@1 curves, stability (KL to the sampler policy, importance-ratio statistics, gradient norm), and final held-out accuracy for both methods at each k. - Smallest test: 2 methods x about 3 lag levels x 2-3 seeds, short runs. - Spindle/Tinker fit: a Tinker-style API normally decouples sampling from training, so lag can likely be induced by sampling from an older saved sampler checkpoint. Confirm whether Spindle supports this. If the paper's method needs full-model access, custom losses, or logprobs beyond what the API exposes, that part may not carry over. This cannot be assessed from the retrieved text. - Compute: not stated; likely modest for a small-model LoRA run. - Note: the Slack thread shows the exchange run was only a smoke test with 0 training steps, so no empirical result exists yet.

context: The idea asks whether TailRL is more fragile than GRPO under off-policy staleness from asynchronous rollouts, which matters for production runs where inference and training overlap. GRPO is the explicit baseline. The thread's bot messages ('smoke test: no training happened', 'steps 0') and Micah's note ('Sorry ignore, just testing the Slackbot UI flow') show the exchange pipeline was being tested, not that the idea was evaluated. The idea itself (the first paragraph) is still legitimate. Modal's team might care because async rollout is a practical throughput lever, and a method that only works synchronously would be hard to adopt.

caveats: The brief rests on a title-page-only retrieval, so the claim, method and evidence are all unknown. The idea's premise that the original experiments were purely sync is unverified. The arXiv ID (2609.02987) should be checked, since it may be mistyped or a placeholder. Any experiment design here is conditional on reading the actual paper. Staleness handling may also interact with GRPO details such as importance-ratio clipping, so the comparison needs matched correction mechanisms (e.g., clipping or truncated importance sampling applied equally to both methods). Otherwise differences may reflect the correction rather than the method.

The linked idea text says TailRL has a 'compelling' theory/explanation and that its original experiments were purely synchronous. Neither statement can be checked against the retrieved text.",
"context": "The idea asks whether TailRL is more fragile than GRPO under off-policy staleness from asynchronous rollouts, which matters for production runs where inference and training overlap. Modal's team might care because async rollout is a practical throughput lever, and a method that only works synchronously would be hard to adopt.",
"evidence": "None available. The source text has no results, models, datasets, baselines or numbers. The retrieved text is effectively truncated to the title page. Claims in the idea text (sync-only experiments, strong theory) are the idea author's characterization and are unverified here.",
"method": "Not stated. Before designing anything, fetch the arXiv abstract and paper (the idea links arxiv.org/abs/2609.02987; that ID looks unusual and should be verified) to get the actual update rule.",
"reproduction": "The method cannot be specified from this source, so only the experimental frame for the idea's question is given.\n- Data and eval: choose a verifiable-reward task (e.g., math with exact-match reward) on a small open model such as a Qwen3.5 small variant with LoRA. Use the paper's own tasks if they can be recovered from the full text.\n- Implementation: TailRL's loss must be taken from the paper. GRPO is the baseline, with the same data, reward, LoRA rank, learning rate, group size and step budget.\n- Core manipulation: rollout lag k, meaning rollouts are sampled from a policy k optimizer steps stale. Sweep k in {0, 1, 2, 4, 8} (suggested values, not from the source), with k=0 being the sync control. Report reward/pass@1 curves, stability (KL to the sampler policy, importance-ratio statistics, gradient norm), and final held-out accuracy for both methods at each k.\n- Smallest test: 2 methods x about 3 lag levels x 2-3 seeds, short runs.\n- Spindle/Tinker fit: a Tinker-style API normally decouples sampling from training, so lag can likely be induced by sampling from an older saved sampler checkpoint. Confirm whether Spindle supports this. If the paper's method needs full-model access, custom losses, or logprobs beyond what the API exposes, that part may not carry over. This cannot be assessed from the retrieved text.\n- Compute: not stated; likely modest for a small-model LoRA run.\n- Note: the Slack thread shows the exchange run was only a smoke test with 0 training steps, so no empirical result exists yet.",

They also share the same token-level importance correction against the sampler's logprobs. That correction is the stock tinker importance_sampling objective, with ratio truncation at 2.0 applied identically to every arm, so differences come from the method and not the correction. Lag k means each step's rollouts are drawn from the sampler weights saved at optimizer step t-k. Every step's weights are saved with save_weights_for_sampler and kept in a ring buffer of k+1. 31/100 · The preflight gating is good, but the shared lr 4e-5 across GRPO and TailRL is the problem. Give each method a small LR grid under equal budget, select on final eval, and add an edge rule. Add a one-step probe of the TailRL custom-loss client. Dealbreaker, untuned-baseline: GRPO and TailRL, which differ in loss, share one fixed lr of 4e-5 with no per-arm sweep. The interaction contrast cannot separate method sensitivity from LR mismatch. 3/5 capability-probe: Activation-gate pilot and executed_base_model check cover pieces, and the restoration_preflight lists optimizer configs, but no explicit one-step probe of each arm's forward_backward_custom TailRL client is stated. 1/5 tuning-parity: All four arms share one untuned lr 4e-5, no per-method grid, no edge rule; TailRL and GRPO may have different optimal LRs, confounding the interaction contrast. 3/5 riskiest-assumption: The unknown TailRL update rule is named and the run is blocked on correctness_preflight, and the activation gate checks lag KL, but the gate does not cover a mis-implemented TailRL. 67/100 · Data and GRPO baseline are well pinned, but you can't audit this until TailRL's update rule and defaults are pulled from the paper. Fetch it, pin the revision, and add more seeds, since a 0.03 interaction at seed 0 is noise-prone. 5/5 data-available: openai/gsm8k train for training (5120 examples) and test split (1319) for eval, both named exactly with hf_path and split. 3/5 stock-tooling: Needs custom TailRL loss via forward_backward_custom plus a lag ring buffer; GRPO side is stock, but TailRL update rule is unknown. 3/5 rerunnable: Optimizer, LR, steps and arms are pinned with seed 0, but TailRL hyperparameters and paper revision are unpinned, and a single seed limits reruns. 3/5 claim-evidence: arXiv 2609.02987 and a project site exist, but the paper wasn't fetched and no numbers or code were verified; the lag-sensitivity claim is speculation. 59/100 · The 2x2 interaction design is clean. Fetch the paper first. Then run the 8-step lag-4 pilot on a smaller model, since one seed can't resolve a 0.03 interaction. Write the ladder: add seeds, then lags 2 and 8, then scale up the model. 4/5 one-variable: Clean 2x2 with shared correction, data, seed, LR; the interaction contrast isolates lag. But TailRL may bundle its own hyperparameters and loss path, a small incidental difference. 3/5 smallest-version: Qwen3.5-2B, 40 steps, 128 batch, full 1319 test is moderate. Single seed with 0.03 effect is noisy; could use smaller model and shorter runs. 3/5 incremental-path: Has an 8-step pilot with activation gates, but no spelled-out ladder after the result: more seeds, other lags, larger model are unmentioned. 44/100 · The question is worth asking, but it's not yet an experiment: you haven't read TailRL's update rule, so you can't say why it should be lag-fragile. Fetch the paper, state the mechanism, check for existing async-GRPO results, and ask in channel. Single seed with a 0.03 effect is also weak. 3/5 novelty: Known method (TailRL) in a new setting: async lag with GRPO as control. Lag sensitivity is a real open question, though the 2x2 design is standard. 3/5 positioning: Cites TailRL (arXiv 2609.02987) and says it was sync-only, but gives no async RL prior work (e.g. off-policy GRPO, IS correction) and no TailRL mechanism. 3/5 duplication-risk: Source thread shows only a smoke-test run (steps 0, 'ignore'). No evidence of real prior work, but nobody has been asked whether async TailRL was tried. 2/5 insight: The source says TailRL's theory is compelling, but the idea never explains why tail-focused weighting would amplify staleness. Hypothesis of a 0.03 gap is unargued. Prior Art rubric v1

56/100 · Async tolerance is a real production question, and the lagged-sampler loop is a useful Spindle recipe. But fetch and pin TailRL first, and a single seed at 40 steps won't resolve a 0.03 interaction on GSM8K. 3/5 customer-action: Customers weighing async RL for production would care whether TailRL tolerates lag versus GRPO, but a single 2B GSM8K run is only one input. 3/5 recipe-potential: Lag-via-ring-buffer sampler checkpoints with save_weights_for_sampler is reusable, but TailRL's update rule is unknown and 1-seed results need cleanup before copying. 4/5 product-feedback: Exercises forward_backward_custom with importance-sampling loss and repeated save_weights_for_sampler checkpointing in a lagged RL loop, which are fragile, less-tested paths. 3/5 story: The two-sentence story is clear (TailRL drops X vs GRPO's Y at lag 4), but the interaction contrast and single seed need a caveat. 58/100 · Design is careful, but the interaction contrast across four single-seed arms can't resolve a 0.03 gap: eval SE alone is ~1.3pp per arm, ~2.6pp on the interaction. Run at least 3 seeds per arm, estimate seed variance, and tune LR per method before concluding anything. 4/5 falsifiable-hypothesis: Threshold set: TailRL's lag0→lag4 drop exceeds GRPO's by ≥0.03 absolute on GSM8K. Good, though 0.03 isn't justified against noise and TailRL's rule is unspecified. 3/5 fair-baseline: GRPO shares data, model, steps, LR, and IS correction, but LR 4e-5 is shared rather than tuned per method, which may favor one arm. 4/5 confounds: Strong controls: shared IS truncation, data order, group size, and a lag/KL activation gate. Residual risk: TailRL's paper hyperparameters and LR interaction are unknown. 1/5 noise: Every arm uses seed 0, so there is one seed. The primary endpoint is an interaction of four noisy numbers; the 1319-question test SE is ~1.3pp per arm, so a 0.03 interaction is within noise. 4/5 eval-validity: GSM8K test with exact match and greedy decoding is held-out and standard. Weaknesses: only the final checkpoint, and 40 steps may not show lag effects. Reviewer 2 rubric v1

38/100 · Add a TailRL lag-0 reproduction against the paper's reported sync gain, multiple seeds to size noise against your 0.03 threshold, and an explicit stop rule. Otherwise a null can't distinguish no effect, noise, or a wrong TailRL implementation. 3/5 riskiest-assumption: Activation gate implicitly tests lag-4 KL and TailRL weight divergence first, but the riskiest assumption (TailRL implementable correctly from an unfetched paper) isn't named as such. 2/5 negative-result-value: Single seed, 40 steps, 0.03 threshold on 1319 examples: noise (~±0.013 SE) likely swamps interaction; flat result can't separate idea from noise or TailRL misimplementation. 3/5 setup-sanity-checks: Good lag-step, KL ratio, truncation, and divergence checks, but no baseline reproducing a known GSM8K number or TailRL paper's sync result. 2/5 kill-criteria: Activation gate thresholds halt the pilot, but no stated result (e.g., interaction CI includes zero) ends the line of work. 47/100 · Affordable at about 1–1.5 GPU-hours, but one seed can't resolve a 0.03 interaction at n=1319. Spend the spare budget on 2–3 seeds per arm, add the training-reward gap and KL as secondary endpoints, and gate on the 8-step pilot first. 4/5 budget-fit: 4 arms × 40 steps × 128 rollouts at ≤512 tokens, plus 4 evals of 1,319 problems and an 8-step pilot, is roughly 1–1.5 GPU-hours. Only one seed fits. 2/5 signal-per-gpu-hour: One seed per arm, and the 0.03 interaction is about one standard error from test-set sampling alone. Spending on more seeds, or on training reward and KL, would be more decisive. 2/5 small-scale-validity: 40 steps with lag 4 at LoRA lr 4e-5 on a 2B model may barely diverge. Prod async lag at larger scale and longer runs is unargued. 3/5 throughput-risk: Sampling dominates wall clock. Saving sampler weights every step, forward_backward_custom overhead, and Qwen3.5 output lengths up to 512 tokens need a timing pilot first. Compute Hawk rubric v1
